Abstract. Whole-brain multivariate pattern analysis is widely assumed to outperform region-of-interest approaches by leveraging distributed neural representations. We tested this assumption by training linear support vector machine decoders on six fMRI task datasets—including the Human Connectome Project working memory and motor tasks, the Haxby face/object paradigm, and three additional cognitive paradigms—systematically varying the number of ANOVA-selected voxels from 10 to 5,000. Classification accuracy saturated at approximately 200 voxels across all six tasks, reaching 95% of maximum performance regardless of total ROI size, task difficulty, or individual subject. Beyond this threshold, additional voxels contributed noise without improving discriminability. The saturation curve was well-described by a logarithmic model (, for all tasks), with the inflection point consistently falling between 150 and 250 voxels. Cross-validated permutation testing confirmed that accuracy gains beyond 200 voxels were not statistically significant ( for all comparisons). These results establish a practical voxel selection ceiling for linear fMRI decoding and challenge the prevailing assumption that whole-brain analyses extract meaningful additional signal beyond a compact, informative feature set.
1. Introduction
1.1 Multivariate Pattern Analysis in Neuroimaging
The shift from univariate activation mapping to multivariate pattern analysis (MVPA) transformed cognitive neuroscience by demonstrating that information about mental states is encoded in distributed patterns of neural activity [1]. Rather than asking which brain regions respond to a stimulus, MVPA asks whether the spatial pattern of responses across voxels contains sufficient information to classify the cognitive state. This approach has successfully decoded visual categories [2], action intentions [3], emotional states, and even subjective experiences from fMRI data.
1.2 The Feature Selection Problem
A standard fMRI volume contains 50,000–200,000 brain voxels, most of which carry no task-relevant information. Including all voxels in a classifier introduces noise dimensions that degrade performance—the curse of dimensionality. Feature selection methods, typically ANOVA F-tests or searchlight approaches, identify the most informative voxels before classification. The critical question is: how many voxels are needed for optimal decoding?
The prevailing assumption in the field favors whole-brain or large-ROI approaches. The reasoning is that cognitive processes are distributed across brain networks, so restricting analysis to a small region risks missing relevant information. Searchlight methods [4] implicitly assume that local neighborhoods of 100–300 voxels can capture meaningful patterns, but no systematic study has determined whether increasing the voxel count beyond such numbers actually improves classification.
1.3 Information-Theoretic Framing
From an information-theoretic perspective, the classification accuracy achievable from voxels depends on the mutual information between the voxel pattern and the class label:
where is the pattern of selected voxels and is the class label. If the top- voxels capture all task-relevant information, then and adding more voxels cannot improve classification. The question is empirical: at what does saturate?
1.4 Study Design
We designed a systematic voxel titration experiment across six fMRI datasets spanning motor, visual, cognitive, and social processing domains. For each dataset, we trained linear SVM classifiers with voxel counts ranging from 10 to 5,000, selected by ANOVA F-score ranking, and measured classification accuracy under nested cross-validation. This design isolates the effect of feature set size from confounds of classifier complexity, preprocessing choices, and task design.
2. Related Work
2.1 Foundational MVPA Studies
Haxby et al. (2001) demonstrated that distributed patterns of fMRI activity in ventral temporal cortex could distinguish between eight visual object categories, launching the MVPA era [2]. Their analysis used all voxels within an anatomically defined ROI (approximately 500–1,000 voxels), but did not systematically vary the voxel count. Norman et al. (2006) reviewed the emerging MVPA field and noted the feature selection challenge without providing quantitative guidance on optimal voxel counts [1].
2.2 Feature Selection Methods
De Martino et al. (2008) compared recursive feature elimination with ANOVA selection for fMRI decoding and found that both methods converged on similar accuracy levels with 200–500 voxels [5]. However, they tested only one dataset (auditory cortex) and did not systematically map the accuracy-vs-voxels curve. Pereira et al. (2009) provided a tutorial recommending feature selection but offered no specific guidance on optimal feature counts [6]. Varoquaux et al. (2017) demonstrated that simple feature selection often outperforms complex approaches for neuroimaging, but focused on prediction pipelines rather than the saturation question [7].
2.3 Dimensionality in Neural Codes
Theoretical work on neural coding suggests that stimulus information in cortical populations saturates with relatively small numbers of neurons due to shared noise correlations [8]. Moreno-Bote et al. (2014) showed that correlated neural noise limits the information extractable from large populations, implying a natural ceiling on useful dimensionality. Whether this theoretical prediction extends to fMRI voxels—each averaging over millions of neurons—remained untested at scale.
2.4 Whole-Brain vs. ROI Decoding
Several studies have compared whole-brain and ROI-based decoding, with conflicting conclusions. Etzel et al. (2009) found that whole-brain searchlight outperformed anatomical ROIs for action observation decoding. Conversely, Jimura and Poldrack (2012) reported that anatomical ROI-based classification matched or exceeded whole-brain performance for cognitive control tasks. These conflicting findings may reflect the fact that neither approach controlled for the number of voxels entering the classifier, confounding feature count with spatial extent.
3. Methodology
3.1 Datasets
We analyzed six publicly available fMRI datasets spanning distinct cognitive domains:
Dataset 1 (HCP-WM): Human Connectome Project working memory task. subjects, 2-back vs. 0-back classification, 2 mm isotropic resolution, TR = 720 ms. Total brain voxels after masking: ~180,000.
Dataset 2 (HCP-Motor): HCP motor task. subjects, left hand vs. right hand vs. tongue vs. foot classification (4-class), same acquisition parameters.
Dataset 3 (Haxby): Haxby et al. (2001) face/object dataset. subjects, 8-category classification (faces, houses, cats, bottles, scissors, shoes, chairs, scrambled), 3.5 mm isotropic, TR = 2,500 ms. Total voxels: ~40,000.
Dataset 4 (Emotional): HCP emotion processing task. subjects, fearful face vs. neutral shape classification.
Dataset 5 (Social): HCP social cognition (theory of mind) task. subjects, mental interaction vs. random motion classification.
Dataset 6 (Language): HCP language task. subjects, story vs. math classification.
3.2 Preprocessing
All datasets were preprocessed using fMRIPrep v21.0 with default parameters: motion correction, slice timing correction, normalization to MNI152 2 mm space, and 6 mm FWHM spatial smoothing. A gray matter mask was applied to restrict analysis to cortical and subcortical gray matter voxels. Beta maps were estimated using a general linear model with condition regressors convolved with a canonical hemodynamic response function.
3.3 Voxel Selection
For each cross-validation fold, voxels were ranked by ANOVA F-score computed on the training set only (to prevent information leakage). The F-score for voxel is:

3.4 Classification
Linear SVM classifiers (LIBSVM implementation, ) were trained on the selected voxel features. For multi-class problems (HCP-Motor, Haxby), we used one-vs-rest decomposition. Performance was evaluated using stratified 5-fold cross-validation repeated 10 times, yielding 50 accuracy estimates per voxel count per subject.
The decision function for a linear SVM is:

3.5 Saturation Curve Modeling
To quantify the saturation behavior, we fitted a logarithmic model to the accuracy-vs-voxels curve:
and defined the saturation point as the smallest where accuracy reached 95% of the asymptotic maximum:
We also fitted a power-law model to compare functional forms.
3.6 Statistical Testing
To test whether accuracy at was significantly different from accuracy at , we performed paired permutation tests across subjects. For each dataset, we computed the within-subject accuracy difference and tested whether was significantly greater than zero using 10,000 permutations of the sign vector.
4. Results
4.1 Saturation Curves
Classification accuracy increased steeply from 10 to 100 voxels, then plateaued between 150 and 250 voxels across all six datasets. The saturation was remarkably consistent despite large differences in baseline accuracy (ranging from 64% for 8-class Haxby to 94% for HCP-WM binary).
Table 1 reports classification accuracy at key voxel counts for all six datasets.

The mean saturation point across datasets was voxels (SD = 22, range 165–230). The logarithmic model provided excellent fits ( for all datasets), while the power-law model yielded comparable fits () with exponents ranging from 0.08 to 0.14, consistent with a rapidly decelerating curve.
4.2 Statistical Tests of the Saturation
Paired permutation tests comparing accuracy at vs. confirmed that the differences were not statistically significant for any dataset.

All effect sizes were negligible (), and no comparison reached conventional significance (). Notably, for three datasets (HCP-WM, Haxby, HCP-Language), accuracy at was numerically lower than at , consistent with noise accumulation degrading classifier performance.
4.3 Invariance Across ROI Size
To test whether the saturation point depends on the spatial extent of the candidate voxel pool, we repeated the analysis restricting voxel selection to anatomical ROIs of varying size: small (V1, ~1,500 voxels), medium (lateral occipital cortex, ~5,000 voxels), large (entire temporal lobe, ~25,000 voxels), and whole-brain (~180,000 voxels). Using the Haxby dataset where all ROIs contained task-relevant information:
For V1 ROI (): saturation at voxels, peak accuracy = 54.2%. For LOC ROI (): saturation at voxels, peak accuracy = 63.8%. For temporal lobe (): saturation at voxels, peak accuracy = 64.1%. For whole-brain (): saturation at voxels, peak accuracy = 64.5%.
The saturation point varied by only 35 voxels across a 120-fold range in ROI size, confirming that the ceiling is determined by the signal structure rather than the available feature space. Peak accuracy did improve with larger ROIs (because more informative voxels were available for selection), but the number of voxels needed to achieve that peak remained constant.
4.4 Subject-Level Analysis
We examined whether the saturation point varied across individuals. For the HCP-WM dataset (), subject-level values ranged from 110 to 280, with a median of 180 and interquartile range of 155–215. There was no significant correlation between and overall decoding accuracy (, ), head motion (, ), or temporal signal-to-noise ratio (, ). The stability of across subjects with varying data quality supports the interpretation that the saturation reflects a property of the neural code rather than a measurement artifact.
4.5 Effect of Classifier Choice
To verify that the saturation is not an artifact of linear SVM, we repeated the HCP-WM analysis with three additional classifiers: logistic regression, linear discriminant analysis (LDA), and a 2-layer neural network (128 hidden units, ReLU activation). All classifiers showed saturation between 175 and 250 voxels. The neural network saturated at , slightly later than the linear methods (–), suggesting that nonlinear classifiers can extract marginally more information from additional voxels but do not fundamentally alter the saturation phenomenon. The absolute accuracy at saturation was nearly identical across classifiers (range: 92.8%–94.1%), consistent with prior findings that linear classifiers suffice for fMRI decoding [1].
4.6 Information-Theoretic Analysis
We estimated the mutual information using the Kozachenko-Leonenko nearest-neighbor estimator for each voxel count. Consistent with the classification results, followed a logarithmic saturation:
with for all datasets. The estimated total mutual information at was 94.3% of the estimate at (averaged across datasets), closely matching the 95% threshold defined by classification accuracy.
5. Discussion
5.1 Interpreting the Ceiling
The 200-voxel saturation point admits two complementary interpretations. First, from a signal processing perspective, fMRI voxels average over approximately 1 million neurons each, meaning that the top 200 most informative voxels integrate responses from neurons. This is a substantial sampling of any cortical network, and the redundancy structure of cortical representations means that additional sampling provides diminishing returns.
Second, from a statistical perspective, the effective dimensionality of task-related fMRI signals is low. Principal component analysis of the selected voxels consistently shows that 10–20 components explain >90% of the variance in task-related activity. With only 10–20 effective dimensions, 200 voxels provide approximately 10x oversampling, which is sufficient for stable linear classification but would not benefit from further oversampling.
The saturation phenomenon is formally related to the bias-variance tradeoff in classification. With features and training samples, the expected generalization error can be decomposed as:
Increasing reduces bias (more information available) but increases variance (more parameters to estimate from fixed ). The optimal balances these terms, and for typical fMRI sample sizes (–), this balance occurs at .
5.2 Relationship to Neural Coding Theory
The observed saturation aligns with theoretical predictions about information scaling in correlated neural populations. Moreno-Bote et al. (2014) showed that shared noise correlations limit the information extractable from large populations, with information scaling as rather than for positively correlated neurons [8]. At the voxel level, spatial correlations induced by hemodynamics, vasculature, and shared inputs create an analogous redundancy structure, producing the logarithmic saturation we observe.
5.3 Practical Recommendations
These findings have direct methodological implications. First, whole-brain MVPA is computationally wasteful for linear decoding: restricting analysis to the top 200 ANOVA-selected voxels reduces computation by 100–1000x while sacrificing no accuracy. Second, the finding undermines a common justification for whole-brain approaches—that they capture distributed representations missed by ROI analyses. While whole-brain voxel selection does identify the most informative voxels regardless of anatomical boundaries, only 200 of them are needed. Third, the consistency of across tasks, subjects, and ROIs provides a practical default for feature selection that eliminates the need for expensive nested cross-validation over .
5.4 When the Ceiling Might Not Hold
We anticipate that the 200-voxel ceiling may not hold in specific circumstances: (1) tasks requiring integration of truly independent information streams (e.g., audiovisual integration where visual and auditory cortex carry non-redundant information), (2) datasets with very high spatial resolution (submillimeter fMRI) where voxels capture finer-grained patterns, (3) nonlinear classifiers with sufficient training data to exploit high-dimensional interactions, or (4) resting-state functional connectivity analyses where the feature space is voxel pairs rather than individual voxels. Our results apply specifically to task-evoked activation patterns decoded with linear classifiers at standard (2–3 mm) resolution.
5.5 Limitations
Several limitations qualify these findings. First, we used ANOVA F-score for voxel selection, which is a univariate filter method. Multivariate selection methods (e.g., recursive feature elimination, elastic net) might identify different voxel subsets with different saturation properties, though De Martino et al. (2008) found convergent results across selection methods [5]. Second, our analysis focused on classification accuracy as the performance metric. For regression-based decoding (e.g., predicting continuous stimulus parameters), the saturation point might differ. Third, all datasets used standard (2–3 mm) spatial resolution. High-resolution 7T fMRI data, where individual voxels capture column-level patterns, might exhibit different scaling behavior. Fourth, we tested only task-evoked paradigms with block or event-related designs. Resting-state decoding, which relies on connectivity patterns rather than activation magnitudes, operates in a fundamentally different feature space. Fifth, the sample size for the Haxby dataset () limits the statistical power of subject-level analyses for that dataset specifically, though the consistency with the larger HCP datasets () mitigates this concern.
6. Conclusion
We demonstrate that fMRI classification accuracy saturates at approximately 200 ANOVA-selected voxels across six cognitive tasks, four classifiers, and diverse ROI sizes. The saturation point is invariant to task difficulty, subject identity, and the total number of available voxels. Beyond this ceiling, additional features introduce noise without providing discriminative signal, resulting in flat or declining accuracy curves. These findings establish a practical upper bound on useful feature dimensionality for linear fMRI decoding at standard resolution and challenge the assumption that whole-brain multivariate analyses extract meaningfully more information than compact, targeted feature sets. We recommend adopting as a default feature count for linear fMRI decoding, eliminating the need for computationally expensive feature count optimization while maintaining near-optimal classification performance.

## Overview

## Common Pitfalls
- Feature selection leakage: using all data for ANOVA then splitting for classification inflates accuracy and can shift the apparent saturation point

- Insufficient CV repetitions: single 5-fold CV has high variance; use 10 repetitions
